How to Build a RAG System With Anthropic Claude on AWS

Retrieval-augmented generation (RAG) has become the go-to method for enhancing large language models (LLMs). RAG helps tackle challenges like outdated information, high computational costs, and hallucinations, making it ideal for many real-world applications. At its core, RAG enhances an LLM by connecting it with external, domain-specific data sources to improve accuracy and relevance.

If AWS is part of your cloud stack, Amazon Bedrock makes it easy to build an efficient RAG system. It provides access to top-tier foundation models from leading AI companies like Anthropic, allowing you to develop and scale generative AI applications securely on AWS.

In this guide, we’ll show you how to build a RAG system in JavaScript using Anthropic’s Claude Sonnet-3.5, Bedrock embedding models, and pgvector to manage vector embeddings in PostgreSQL. This approach lets you quickly integrate RAG features into your existing AWS applications.

Understanding RAG Systems

RAG systems augment an LLM’s context with relevant data retrieved from data stores or APIs. By enriching the LLM’s context with external information, RAG systems help reduce hallucinations and improve response accuracy.

In a typical RAG system, data points are first converted into vector embeddings—numerical representations that capture key features of the data. When a user submits a query, it is also converted into embeddings, and a similarity search is performed between the query embeddings and the stored data embeddings. This process retrieves the most semantically relevant results, ensuring more accurate and contextually relevant responses.

Traditionally, RAG systems made use of specialized vector databases. However, as we’ve discussed, vector databases are the wrong abstraction, and you can easily achieve everything that vector databases offer by using pgvector, pgai, and pgvectorscale with PostgreSQL. The beauty of this approach is that your data and embeddings remain in the same store, eliminating the need for extra infrastructure.

Architecture overview

Let’s take a quick look at the stack we’ll use here:

Amazon Bedrock: a managed AI service for integrating foundation models into applications
Anthropic Claude Sonnet 3.5: an LLM optimized for reasoning and generating enriched responses
Embedding model: converts text into vector embeddings for similarity search
Pgvector: a PostgreSQL extension for storing and querying high-dimensional vector embeddings

Workflow of the RAG System

For this guide, we’ll use the Cohere/movies dataset. Here’s an overview of the workflow:

Load and store dataset: Fetch the dataset from Hugging Face and store metadata with vector embeddings in PostgreSQL using Amazon Bedrock.
Vector search: Perform similarity search (cosine or Euclidean) to find matching movies.
AI Recommendation: Use Claude Sonnet-3.5 to generate context-aware suggestions.

Implementation Steps

1. Setting up and configuring Amazon Bedrock

First, sign in to the AWS Management Console, search for Amazon Bedrock, and open the service.

If you're new to AWS, make sure your billing is set up. Next, you'll need access to the Claude 3.5 Sonnet model for generating responses and Titan Text Embeddings V2 for vectorizing movie descriptions.

Before using the models, first request access to them.

In the Amazon Bedrock dashboard, go to the Model Access tab.
Look for Anthropic Claude 3.5 Sonnet, and Titan Text Embeddings V2.
Click Request Access for both models.

AWS may take some time to approve your request, so check back periodically if access isn’t granted immediately.

Click on each model to open its details page.
Here, you’ll find API references, pricing details, and usage guidelines.

To integrate these models into your project, you’ll need the API endpoints and request formats.

On each model’s page, navigate to the API Reference section.
Take note of the endpoint, required parameters, and authentication details.
You’ll use this information later when making API calls from your Node.js backend.

2. Installing and running PostgreSQL with Docker

We’ll use a preconfigured Docker container by pgai to set up PostgreSQL locally. This Docker image comes with pgvector pre-installed, making it easy to get started.

3. Installing Node.js

Download and install the LTS version of Node.js, which includes npm for managing dependencies. Once installed, verify the installation using:

4. Setting up the project

With your project environment ready, it's time to install the required dependencies and configure both the AI model and database clients.

Step 1: Install the required packages

Next, install the essential npm packages needed for this project:

pg: enables PostgreSQL connectivity, allowing you to store and retrieve vector embeddings

axios: an HTTP client for making API requests, used for fetching external datasets
@anthropic-ai/sdk: simplifies interaction with Claude AI for AI-generated responses and recommendations

Step 2: Set up AWS and Anthropic environment variables

To connect to Amazon Bedrock and Claude AI, you need to store your API credentials securely.

Create a .env file in your project directory and add:

Let’s create a function to load the Cohere/movies dataset from Hugging Face.

Above, we’re using the <-> operator in pgvector, which applies the L2 distance metric to retrieve the most relevant movies by measuring the distance between the query vector and stored embeddings.

Now that all the components are in place, we’ll create a function to connect to PostgreSQL, load the movie dataset, generate embeddings, and efficiently insert the data.
